Anatomy of an AI trace: LLM, tool and retrieval spans on a timeline

Everyone is shipping AI. Far fewer teams can actually prove it works. The skill that separates the two is observability — and the good news is you can get most of the way there with free, self-hostable tools. This is the companion guide to our AI, for real episode on observability & tracing: the words that matter, the top tools (open-source and paid), and how to choose.

First, the words that matter

  • Observability — being able to ask any question about why your system behaved a certain way, without shipping new code to find out. (OpenTelemetry)
  • Monitoring — watching a fixed set of known metrics and alerting when they cross a line; you decide the questions in advance. Monitoring is a subset of observability. (Google SRE Book)
  • Tracing — the full end-to-end timeline of a single request. A span is one step inside it (one model call, one tool call, one retrieval), with its own timing and metadata. (OpenTelemetry)
  • Evals — grading your AI's outputs against a rubric (correctness, faithfulness, safety), automatically and repeatedly, offline and in production. (Langfuse)

Tracing tells you what happened; evals tell you whether the output was good. You need both.

Why it matters

AI systems fail quietly. Gartner predicts over 40% of agentic AI projects will be cancelled by the end of 2027, citing cost, unclear value, and weak controls. Reported AI incidents hit a record 233 in 2024, up 56% year over year (Stanford HAI 2025 AI Index). And models drift silently: researchers found GPT-4's accuracy on one task fell sharply over just a few months — same model, same prompt (arXiv:2307.09009). Without observability, you learn about these when your users do.

Top 5 open-source tools (2026)

ToolLicenseBest for
LangfuseMIT core (now under ClickHouse)Default pick — broadest features (trace + eval + prompt + cost), largest community, full self-host.
Opik (Comet)Apache-2.0Strongest fully-open platform with excellent evals and zero commercial-license strings.
HeliconeApache-2.0Gateway/proxy model — one-line integration plus caching, rate-limits and cost governance.
LaminarApache-2.0Agent-heavy workloads — fast, agent-first tracing.
OpenLLMetryApache-2.0Vendor-neutral OpenTelemetry instrumentation — feeds any backend, no lock-in.

Note: Arize Phoenix is popular but uses the Elastic License (source-available, not OSI-open); Lunary's repository is no longer available. Verified 2026-09-23.

Top 5 paid tools (2026)

ToolFromBest for
LangSmith$39/seat/moBest all-rounder, unbeatable if you're on LangChain/LangGraph.
Braintrust$249/moEval-driven development — gate deploys on quality regressions.
Arize AX$50/mo (unlimited users)Scale + hybrid classic-ML/LLM; self-host/BYOK at enterprise.
Helicone Cloud$79/moCheapest low-friction proxy logging + cost tracking (OSS-backed).
Datadog LLM Observabilityusage-basedBest if you already run Datadog (watch usage-based billing).

How to choose

  • Self-host / full ownership → Langfuse (MIT) or Opik (Apache-2.0).
  • Cheapest request + cost logging → Helicone.
  • On LangChain / LangGraph → LangSmith.
  • LlamaIndex / custom / multi-framework → Langfuse or OpenLLMetry (OTel-native, no lock-in).
  • Eval quality as a CI gate → Braintrust (paid) or Langfuse/Opik (open-source).
  • Agent-heavy (many tool calls) → Laminar, Langfuse, or LangSmith (LangGraph).
  • Already on Datadog or W&B → use their native LLM module.
  • Enterprise hybrid ML + LLM at scale → Arize AX.

The honest starting point for most teams: self-host Langfuse, instrument with OpenTelemetry, add a small eval set, and run it on a schedule. You can't fix what you can't see — and tracing is how you finally see.
